Agentic AI in Production Looks Like a Workflow

Here is the thing that nobody tells you when you start building AI agents for production: the moment your system actually works, it stops looking like an agent.

This bothered me for a while. You read about autonomous agents that reason, plan, use tools, loop back on themselves. You build something that does all of that. And then you deploy it to a real environment — with real regulators, real audit requirements, real consequences for a bad output — and almost immediately the system starts acquiring structure. Steps get names. Inputs and outputs get typed. The sequence of operations gets locked down. You end up with something that looks, from the outside, almost exactly like a workflow.

The instinct is to feel like you’ve failed. Like you set out to build something intelligent and ended up with a very expensive flowchart.

That instinct is wrong.

What’s actually happening is that you’ve discovered what production-ready agentic AI actually is. It isn’t a system that does unpredictable things autonomously. It’s a structured workflow where the LLM is handling the branching logic — the kind of branching that would otherwise require you to write an enormous, fragile thicket of if/else conditionals that breaks the moment the world changes. The LLM replaces the brittle part. The scaffolding stays. And the scaffolding is what makes the whole thing auditable, versionable, and explainable to someone in a compliance function who wants to understand what your system did at 2:47pm last Tuesday.

There’s a term I’ve started using for this: Compound Engineering. The idea is that you build a deterministic workflow — a sequence of discrete steps with clear handoff contracts — and you drop LLM steps into the places where the logic is too complex or too context-dependent to enumerate explicitly. Each LLM step has defined inputs, defined outputs, and a scoped set of tools it’s allowed to call. The orchestrator controls the sequencing; it decides what runs next, whether to retry, when to escalate to a human. The intelligence is in the steps. The reliability is in the structure.

What this buys you is enormous. You can version the workflow the same way you version code. You can test each step in isolation. You can log exactly what prompt went in and what came out at every node in the graph. If something goes wrong, you can trace it. If a regulator asks what your system did, you can show them a sequence of logged decisions with the reasoning attached, rather than gesturing vaguely at a language model and hoping they trust you.

The word “agentic” is doing something subtle here. It doesn’t mean the system is autonomous in the sense of doing whatever it wants. It means the system is automating the connective tissue between steps — the logic that figures out what comes next, what information is needed, whether the output of one step is sufficient to proceed. That’s the part that used to be either hand-coded brittle logic or a human making a judgment call. Agentic means the system can handle that routing, that triage, that assembly work, without a person in the loop for every micro-decision. Human judgment stays at the real decision points — the places where the stakes are high enough that you want a person accountable for the call.

This reframe changes how you think about building these systems. The question isn’t “how do I give the agent more autonomy?” The question is “where exactly is the brittle if/else logic hiding, and is this a place where an LLM will do better?” Sometimes the answer is yes. Sometimes — often — the answer is that you just need a better-structured workflow with no LLM in it at all.

The uncomfortable implication is that most of what’s being sold as “agentic AI” in enterprise contexts will, if it actually ships and works, converge on this pattern. The systems that don’t — the ones that stay genuinely open-ended and unpredictable — will stay in demos and research environments, because the real world has requirements that open-ended systems can’t satisfy.

Which raises a question worth sitting with: if the best production AI systems are, structurally, sophisticated workflows, what does that say about the ceiling? Is this a transitional moment where we’re adding structure as a crutch while the underlying models mature — and in a few years, the workflows become unnecessary? Or is the structure not a crutch at all, but the correct answer: that reliable, auditable, human-supervised AI always looks like a workflow, because anything less is not a system you can actually be responsible for?
